Predictive maintenance reduces maintenance costs, waste, and downtime, and improves the safety of process lines. By applying predictive maintenance, the planning of human resources, materials, and spare parts becomes more efficient. In this thesis, two different production processes are used to develop predictive maintenance models. In previous studies, Random Forest methods have been used for prediction of next maintenance. However, econometric methods such as VAR, VAR-EGARCH, and AR are also suitable for predictive maintenance applications. In this study, all these methods were applied to generate predictions of maintenance. This approach makes it possible to obtain prediction results using different methods and to compare their performance in order to identify the most effective prediction model. The study follows a business analytics approach to developing a predictive maintenance schedule.
The first step of the study was to collect historical data and evaluate equipment for which corrective maintenance (CM) had significantly increased waste, downtime, or both compared to days without CM. After this evaluation, the most significant equipment was selected for the prediction of CM.
In prediction validation and goodness-of-fit evaluation, the Random Forest method produced the best results. The VAR and VAR-EGARCH models showed the poorest validation performance, which may be due to the limited length of the available data. After validation and model comparison, the features used in the models were analyzed. The results indicate that downtime and waste do not play a significant role in the prediction models, and only CM and predictive maintenance improved the models. The final predictions were generated using the Random Forest method, and the next failure time and failure frequency were calculated for all seven pieces of equipment. Based on the failure frequency data, it was possible to compare the cost impacts of equipment across different production lines and identify the most critical components for predictive maintenance. Ennakkohuolto vähentää huoltokustannuksia, hävikkiä ja seisokkiaikaa sekä parantaa prosessin turvallisuutta. Ennakkohuollon hyödyntäminen helpottaa henkilöstöresurssien, materiaalien ja varaosien suunnittelua. Tässä työssä rakennetaan ennakkohuoltosuunnitelma kahden tuotantolinjan laitteille. Aikaisemmissa tutkimuksissa ennakkohuoltoa on yleisesti toteutettu Random Forest -menetelmää hyödyntäen. Kuitenkin myös ekonometriset menetelmät, kuten VAR, VAR-EGARCH ja AR, soveltuvat ennustamiseen. Tässä tutkimuksessa näitä menetelmiä käytetään ennakkohuolto-ohjelman rakentamiseen. Useiden menetelmien käyttö mahdollistaa ennusteiden vertailun ja parhaiten suoriutuvan mallin tunnistamisen.
